Introduction
ResNet (Residual Neural Network) was proposed by He Yuming, Zhang Xiangyu, Ren Shaoqing, Sun Jian and others from Microsoft Research. By adding a residual unit (Residual Unit) to the deep neural network, the training depth is more efficient than before. ResNet won the championship in the 2015 ILSVRC competition. Because the network is "simple and practical", many methods have been built on the basis of ResNet50 or ResNet101. ResNet has been used in detection, segmentation, recognition and other fields, and Alpha zero has also used ResNet. The structure of ResNet can accelerate the training of ultra-deep neural network very quickly, and the accuracy of the model has also been greatly improved.
Model degradation
In the early days, people tried to increase the depth of the model to improve the accuracy of the model. As the depth of the model gradually deepened, the accuracy of the model continued to increase. It is found that when the model depth reaches a certain level, increasing the model depth not only does not improve the accuracy rate, but the accuracy rate decreases instead. , but when your network level is further deepened, its performance is not as good as that of the shallow network, which is called degradation.
residual network
ResNet introduces a residual network structure (residual network). Through this residual network structure, the network layer can be made very deep (it is said that it can reach 1000 layers at present), and the final classification effect is also very good. The residual network The basic structure of is shown in the figure below. Obviously, the figure has a skip structure:
Assume that the input of a certain neural network is x, and the expected output is H(x), that is, H(x) is the expected complex potential mapping. If you want to learn such a model, the training will be more difficult; recall the previous assumptions
, If a relatively saturated accuracy rate has been learned (or when the error of the lower layer is found to be larger), then the next learning goal is changed to the learning of the identity map, that is, to make the input x approximate the output H(x), so that Remaining in later layers does not result in loss of accuracy.
In the residual network structure diagram above, through the "shortcut connections" method, the input x is directly transmitted to the output as the initial result, and the output result is H(x)=F(x)+x, when When F(x)=0, then H(x)=x, which is the identity map mentioned above. Therefore, ResNet is equivalent to changing the learning goal, no longer learning a complete output, but the difference between the target value H(X) and x, which is the so-called residual F(x) := H(x) -x, therefore, the subsequent training goal is to approach the residual result to 0, so that the accuracy rate does not decrease as the network deepens.
This residual skipping structure breaks the traditional convention that the output of the n-1 layer of the traditional neural network can only be used as an input to the n layer, so that the output of a certain layer can directly cross several layers as the input of a later layer. , the significance of which is that it provides a new direction for the problem that the error rate of the entire learning model does not decrease but increases by superimposing multi-layer networks.
After "shortcut connections", H(x)=F(x)+x, if the channels of F(x) and x are the same, they can be added directly, so how to add the different channels. The solid line and dotted line in the above figure are to distinguish these two situations:
The Connection part of the solid line indicates that the channels are the same. For example, the first pink rectangle and the third pink rectangle in the above figure are both 3x3x64 feature maps. Since the channels are the same, the calculation method is H(x)=F(x) +x.
The Connection part of the dotted line indicates that the channels are different. For example, the first green rectangle and the third green rectangle in the above figure are feature maps of 3x3x64 and 3x3x128 respectively. The channels are different, and the calculation method adopted is H(x)=F(x )+Wx, where W is a convolution operation used to adjust the x dimension.
In addition to the two-layer residual learning unit mentioned above, there are three layers of residual learning units, as shown in the following figure:
The two structures are respectively aimed at ResNet34 (left picture) and ResNet50/101/152 (right picture), the main purpose of which is to reduce the number of parameters. For conventional ResNet, it can be used in a network with 34 layers or less (left picture); for a deeper network (such as 101 layers), use the right picture, the purpose of which is to reduce the amount of calculation and parameters.
